Notebook 18. Agents and tool use: a safe loop from JSON to trace

Module 18 — hands-on notebook

This is an engineering-disciplined educational pipeline, not a production agent runtime. It follows one request through the complete minimal path:

LLM response → strict Action JSON → schema validation → allow-listed tool → observation → trace → stop.

The calculator treats an expression as data rather than passing it to eval. Only a small bounded arithmetic AST is accepted: numbers, parentheses, + - * / // % **, and unary signs, with limits on tree size, power, and result magnitude. Function calls, names, attributes, indexing, containers, and access to the Python runtime are rejected before execution.

Colab contract: Runtime → Run all completes the mandatory route on CPU in a clean session. The notebook reads no repository files and needs no manual upload, Google Drive, API key, network, or paid service. A frozen Module-18 numerical contract is embedded and verified by SHA-256.

Route:

  1. append-only context economics and KV in KiB/GiB;

  2. a transparent conditional latency estimate and toy CodeAct accounting;

  3. trajectory reliability and the cost of independent retries;

  4. strict JSON and tool-argument contracts;

  5. a bounded arithmetic evaluator without eval;

  6. a deterministic ReAct-like loop with a typed trace;

  7. step, tool-call, observation, and history budgets;

  8. negative protocol and safety tests;

  9. injected instructions and permission checks before writing;

  10. two explicitly denominated subagent speedup conventions.

0. Embedded Module-18 numerical contract

The reference numbers belong to the module and are not derived from lecture prose. The JSON is embedded and checked by SHA-256, so later editorial changes cannot silently alter answers.

1. Loop context and a conditional latency estimate

The immutable base has 3,000 tokens and each of 20 steps appends 1,500. Full re-prefill processes an arithmetic progression; exact prefix caching pays for the base once and then for new suffix positions. This counts input positions and the 2PT2PT approximation, not all attention work: new queries still read earlier keys and values.

KV uses 128 KiB per token, so division by 2**30 is labelled GiB. Latency is not an H100 measurement: it is a transparent conditional arithmetic estimate under stated parameter count, effective FLOP/s, decode throughput, and tool latency.

2. Reliability: independence is an assumption and retry is not free

For step success pp and r retries:

pstep′=1−(1−p)r+1,ptrajectory=(pstep′)N.p_{\mathrm{step}}'=1-(1-p)^{r+1},\qquad p_{\mathrm{trajectory}}=(p_{\mathrm{step}}')^N.

The equation assumes independent attempts. Real retries can be correlated when the prompt and failure mode do not change, so repeating the same action need not buy this improvement. Yet an independent random attempt under an unchanged prompt can help: p=0.8p=0.8 gives 0.960.96 with one retry. We separate the recovery assumption from cost and also compute the expected number of calls.

The formulas assume perfect failure detection and safe retries. In general one retry gives p+(1-p)q, where q is success conditional on first-attempt failure. With detection fraction d, the result is p+(1-p)dq, where q is now conditional on a detected failure; false alarms are not modeled.

3. Structured action: JSON is not a contract

Syntactically valid JSON is not yet an admissible action. We validate:

  • no duplicate object keys at any nesting level;
  • exactly two top-level fields, tool and args;
  • an allow-listed tool name;
  • required and forbidden arguments;
  • each value's type, range, and length;
  • a finite serializable result and an observation-size limit.

A ToolSpec is the source of truth and also emits a stable JSON schema for the prompt, reducing drift between documentation and execution.

4. A calculator without eval

eval(expr, {"__builtins__": {}}) is not a sound safety boundary: it still accepts Python syntax and tends to accumulate dangerous exceptions during later edits. Here no Python code is executed. ast.parse(..., mode="eval") creates a tree and a visitor handles only explicitly allow-listed nodes.

This is a calculator, not a sandbox. A general python_exec tool needs a separate process or VM, CPU/RAM/time limits, filesystem and network policy, secret isolation, and a threat model.

5. A deterministic agent loop and typed trace

The loop does not hide all state in one history string. It returns AgentResult with:

  • a stop status;
  • the final answer;
  • the number of registry invocations, including rejected requests;
  • structured assistant_action / tool_result / tool_error / assistant_final events;
  • final history length.

A tool failure becomes an observation for the next step, but it does not trigger an unbounded automatic retry. The mock LLM must propose a new action.

6. Complete trace: failure → correction → calculation → final

The deterministic script first requests a missing key, then corrects it, calls the calculator, and terminates. Re-running the same script must produce an identical event sequence.

The fictional fixture is sensor_batch=13.96. A deterministic policy responds to observations; no trained LLM is called. The verifier checks 27.92 and the calculator record. Without a verifier the status is answer_proposed. tool_calls includes registry invocations rejected before execution.

8. A document cannot grant tool permissions

The retrieved report contains a sensor value and an unrelated instruction to write a note. This illustrates indirect prompt injection: external data attempts to steer the task. We supply a valid JSON action directly so the experiment tests executor behavior independently of whether a model would follow the injected instruction.

ToolSpec first checks argument shape. A host-supplied TaskGrant, kept outside retrieved text, then determines whether writing to that resource is permitted. The handler runs only after both checks. Notes are dictionary entries, so there is no filesystem effect. Compare a read-only task, an explicit grant for report, and a proposal targeting a different note.

Exactly one write reached the handler: the explicit grant for report. The write_calls ledger verifies rejection before execution rather than relying on a model promise. This does not measure LLM attack resistance or establish that an authorized note is true. Content verification and other tools need their own contracts.

9. Subagents and CodeAct: name the speedup denominator

The ×8.9 ratio compares 45 minutes with 400 minutes of useful work and omits 5 minutes of planning plus 20 minutes of merging from the one-agent baseline. That is a valid but special convention. A strict end-to-end baseline is 425 minutes, producing ×9.44 at N=20N=20; the respective asymptotic ceilings are ×16 and ×17. The notebook prints both so every speedup has an explicit denominator.

The CodeAct comparison remains a toy scenario—450 tokens / 5 round trips versus 160 / 1—not a universal benchmark.

Exercises

  1. [auto] Configure a numeric ArgRule for the interval from 0 to 1. Test both endpoints, values outside them, True, and infinity; explain each rejection.

  2. [auto] Allow the constant pi without allowing arbitrary names; explain why a constant allow-list is safer than an unrestricted Name node.

  3. [auto] Add an idempotency key to ActionRequest and reject a repeated write-like call.

  4. [auto] Implement exponential backoff as a schedule calculation, but do not call sleep on the mandatory notebook path.

  5. [project] Move a general Python tool into a separate container/process with a timeout, read-only filesystem, and disabled network; write the threat model first.

  6. [project] Connect an external LLM while retaining ToolRegistry, AgentLimits, and the tests; measure protocol-error rate, tool-error rate, and trajectory success.

The mandatory route is fully offline. It demonstrates agent-harness contracts; it is not a deployment-ready sandbox or MCP server.

Module 18 project-exercise demo — Verified completion and recovery after failure

Implementation demo, not a completed full-scale project. First observe argument repair and a task-specific completion check. Then lose a response after a SQLite transaction commits: replaying the same operation id avoids a second effect. The second experiment reads ten real files and resumes unfinished work from a checkpoint. All inputs are small, deterministic, offline, and CPU-friendly. The goal is to validate interfaces, metrics, invariants, and report structure before spending GPU or API budget.

Python

np.random.seed(SEED)
print(f"reproducible smoke tier; seed={SEED}")
DEMO_LANGUAGE = 'en'

The first invalid argument becomes an observation that the policy repairs; the completion criterion checks both the answer and tool evidence. Then locate the injected failure: SQLite has committed, but the client has received no reply. Reusing the operation id means replaying that operation. A new id denotes another operation even if its arguments are unchanged.

Replay after the lost reply left the counter at 7; a fresh id raised it to 14. This follows from committing the operation record and effect in one transaction, not from JSON validity or a client-side receipt. A remote service needs its own replay contract.

Each checkpoint entry couples a result with its input hash. Unchanged inputs leave five jobs to run. We then add a second function to one previously processed file and reload the original partial checkpoint. Six jobs now lack a current result. Compare recovery with a fresh sequential analysis over the same files.

# These are deterministic Python workers, not autonomous LLM subagents.
# No wall-clock speedup is claimed for this small I/O and AST workload.

The unchanged inputs contain 10 functions and the revised inputs 11. Both recovered results match fresh analysis. A hash distinguishes an existing result from a current one. Files remain stable while workers run; concurrent editing would require a consistent-snapshot mechanism. This experiment measures neither LLM reasoning quality nor a wall-clock speedup.

Scaling to the full project

Here the operation record and its effect share one transaction. An external service must supply its own idempotency contract; a local log cannot make a remote write atomic. The full project adds a real model, MCP, environment limits, versioned inputs, timing, and quality evaluation. Python workers demonstrate coordination rather than agent intelligence.

Minimum report

  1. Data, model, and code revisions, plus the random seed.

  2. The primary metric, plus quality, cost, latency, and memory where applicable.

  3. A baseline, a matched budget, and at least one negative control.

  4. Failed runs and the limits of the supported conclusions.
